I'm not able to reproduce the problem today on my desktop, but I was
seeing it while travelling recently on a laptop. In that case the
workaround I found was to just turn Bluetooth off on my phone so it
didn't steal the headphones from the laptop. With that said, I fear my
problem might have been different (or multiple bugs).

It would be useful if Tobias and more people could verify the suggested
fix(es) and see if we can direct all related bugs to be duplicates of
bug 2085162.
